Decision Trees (denition)
Decision tree is a classier in the form of a tree structure, where each node is either:
Decision node - species some test to be carried out on asingle attribute-value, with one branch and subtree for eachpossible outcome of the testLeaf node - indicates the value of the target attribute (class)of examples
Decision trees attempt to classify a pattern through asequence of questions.

Very important
For every example, we can compute the probabilities of classes bycounting the percentage of di¤erent classes of examples atthe leaf node where the concerned instance falls into!

Random Forest

Random Forest
Combination of the bagging (random selection of examples)and random selection of features
Random Forest grows many classication trees.
Each tree gives a classication, i.e., it "votes" for that class.
The forest chooses the classication having the most votes(over all the trees in the forest).

Random Forest
Decision Trees RF Stacking Deep Forest (gcForest) Improved Deep Forest (IDF) SDF and DisDF TLDF Weights
Each tree is grown as follows:
1 If the number of cases in the training set is N, sample N casesat random - but with replacement, from the original data.
2 If there are M input features, then m M features areselected at random out of the M and the best split on thesem is used to split the node.
3 Each tree is grown to the largest extent possible. There is nopruning.

Decision Trees RF Stacking Deep Forest (gcForest) Improved Deep Forest (IDF) SDF and DisDF TLDF Weights
Stacking (Wolpert, 1992)
The basic idea is the following algorithm:
1 to train the rst-level learners using the original trainingdata set
2 generate a new data set for training the second-level learner(meta-learner)
3 the outputs of the rst-level learners are regarded as inputfeatures for the second-level learner while the original labelsare still regarded as labels of the new training data.

A general algorithm of stacking
Input: Training data S = f(x1, y1), ..., (xn, yn)g1 Learn T rst-level classiers ht based on S2 Construct new data set S from S :S = f(x1, yi ), ..., (xn, yi )g, where xi = fh1(xi ), ..., hT (xi )g
3 Learn a second-level classier by using the new data set S
Output: An ensemble classier H(x) = h(h1(x), ..., hT (x))

Cascade Forest
Representation learning in deep neural networks mostly relieson the layer-by-layer processing of raw features
gcForest employs a cascade structure, where each level ofcascade receives feature information processed by its precedinglevel, and outputs its processing result to the next level
Each level is an ensemble of random forests, i.e., an ensembleof ensemblesTo encourage the diversity, two complete-random treeforests and two random forests are used
Decision Trees RF Stacking Deep Forest (gcForest) Improved Deep Forest (IDF) SDF and DisDF TLDF Weights
Class vector generation
Given an instance, each forest produces an estimate of classdistribution:
by counting the percentage of di¤erent classes ofexamples at the leaf node where the concerned instancefalls into, then averaging across all trees in the same forest
The class distribution forms a class vector, which is thenconcatenated with the original vector to be input to thenext level of cascade.

Cascade Forest
For 3 classes and 4 forests which produce a three-dimensional class vector- the next level of cascade will receive 12 = 3 4 augmented features.
Number of features generated by a level = number of forests numberof classes

Improved Deep Forest (IDF)
Decision Trees RF Stacking Deep Forest (gcForest) Improved Deep Forest (IDF) SDF and DisDF TLDF Weights
A shortcoming of gcForest
In contrast to neural networks gcForest cannot be controlled, i.e.,we cannot dene a loss function for solving problems di¤erent fromthe standard classication, in particular, distance metric learning, transfer learning and domain adaptation, etc.
Decision Trees RF Stacking Deep Forest (gcForest) Improved Deep Forest (IDF) SDF and DisDF TLDF Weights
How to improve the deep forest?
Main ideas:
1 We can change the class vectors (augmented features) atevery level in accordance with a goal, for example, toconcentrate the semantically similar objects
2 We can do it by introducing weights of trees and computing aweighted average instead of the ordinary average
3 The weights are not assigned by someone. They are trainedjointly with trees on the basis of training data
4 So, we can control the deep forest through control of the classvectors

S = f(xi , xj ) : yij = 0g.

How to implement Siamese NN by using DF?
1 We train every tree by using the concatenation of two vectorsxi and xj such that the class yij 2 f0, 1g is dened by thesemantical similarity of xi and xj . Trees are trained on thebasis of two classes.
2 We assign weights to trees in order to get goodclassvectors. The weights are computed in an optimal way in orderto reduce distances between similar pairs and to increase thembetween dissimilar points.

How to reduce the number ofweights?
Decision Trees RF Stacking Deep Forest (gcForest) Improved Deep Forest (IDF) SDF and DisDF TLDF Weights
Problems of many weights
The Deep Forest was developed in order to signicantlyreduce the number of training parameters which take place inneural networks
The IDF again trains a lot of weights (the number of trees) astraining parameters
We get rid of many parameters in neural network and becomemany parameters in IDF
We can reduce the number of trees in every random forest, but this leads to worse results and this is not a good way

How to reduce the number of weights?

Another weight model
The rst extreme case: the Deep Forest - weights areidentical, i.e. a point in the T -dimensional unit simplex
The second extreme points: the IDF - weights are arbitrary inthe T -dimensional unit simplex
We propose to reduce the set of weights by applying theimprecise statistical models (the linear-vacuous mixture orimprecise ε-contaminated model, the pari-mutuel model, theconstant odds-ratio model)
All these models simply modify the Frank-Wolf algorithm

1 The Deep Forest is a powerfull tool for classication especiallywhen there are no much data
